Abstract

본 학위논문은 획득이 어렵고, 데이터 수가 제한적이며, 잡음이 많고, 복잡한 구조를 갖는 데이터를 위한 딥러닝 방법론을 연구한다. 연구는 전자혀를 활용한 인공 미각 인식에서 시 작하여, 생성모델을 위한 해석 가능한 잠재공간 설계로 확장된다. 전체 연구의 핵심 목표는 데이터 부족과 측정 잡음이 존재하는 환경에서도 강건하게 동작하면서, 데이터의 내재적 기하 구조를 의미 있게 표현할 수 있는 학습 알고리즘을 개발하는 것이다.
전자혀 데이터는 여러 실질적인 한계를 갖는다. 각 센서가 자극에 반응하는 데 시간이 필요하고, 맛의 교차 오염을 방지하기 위한 세척 과정도 요구되기 때문에 측정에 상당한 시간이 소요된다. 또한 반복적인 사용으로 센서가 열화될 수 있으며, 식품 시료는 산화에 의해 변질될 수 있고, 측정 과정에서 이상치가 발생할 가능성도 존재한다. 이러한 특성은 대규모 미각 데이터셋의 구축을 어렵게 하며, 과적합과 이상치 민감도를 증가시킨다. 이를 해결하기 위해 첫 번째 연구에서는 동일한 맛 범주에 속하는 기본 맛 측정값들을 조합하여 사용 가능한 샘플 수를 크게 증가시키는 맞춤형 데이터 증강 기법을 제안하였다. 이후 클래 스 대표값과의 거리에 따라 인코딩된 미각 데이터를 구성하는 프로토타입 기반 딥 신경망 분류기를 적용하였다. 또한 비정상 측정값의 영향을 줄이고 분류 안정성을 향상하기 위해 부트스트랩 샘플링과 보팅 기법을 도입하였다. 와인 데이터를 이용한 실험을 통해, 제안한 방법이 데이터 수가 적고 잡음이 많은 환경에서도 안정적인 분류 성능을 달성할 수 있음을 확인하였다.
두 번째 연구에서는 잠재 표현이 놓이는 공간의 기하 구조에 초점을 맞추었다. 일반 적인 신경망은 인코딩된 데이터가 평평한 유클리드 공간에 존재한다고 가정하지만, 실제 데이터는 계층적이거나 비유클리드적인 관계를 포함할 수 있으며, 이러한 구조는 유클리드 공간에서 효율적으로 표현되지 않을 수 있다. 표현 왜곡을 줄이고 강건성을 향상하기 위해, 딥 신경망으로 추출한 미각 특징을 일정한 음의 곡률을 갖는 쌍곡공간 모델인 Poincaré ball 에 임베딩하였다. 분류는 각 샘플과 Einstein midpoint로 표현된 클래스 프로토타입 사이의 쌍곡거리 계산을 통해 수행하였다. 제안한 모델은 특히 측정 잡음이 큰 조건에서 유클리드 임베딩과 기존의 보팅 기반 방법보다 높은 정확도를 달성하였다. 또한 여러 개의 네트워크 를 사용하는 보팅 구조 대신 단일 네트워크를 사용함으로써 계산량과 학습 시간을 줄였다. 학습에 사용되지 않은 새로운 와인 샘플을 이용한 추가 실험에서는, 학습된 쌍곡 표현이 유사한 기존 와인을 더 효과적으로 식별할 수 있음을 확인하였으며, 이는 미각 기반 추천 시스템으로의 활용 가능성을 보여준다.
마지막 연구에서는 기존의 연속 잠재공간이 명시적이고 해석 가능한 구조를 갖지 못한다 는 문제를 해결하고자, 판별 학습에서 생성모델로 연구 범위를 확장하였다. 이를 위해 고정된 프로토타입 트리를 Poincaré ball에 임베딩하고, 이를 잠재 표현을 구성하는 구조적 기반으로 사용하는 쌍곡 프로토타입-잔차 오토인코더를 제안하였다. 각 인코딩된 샘플은 쌍곡거리에 따라 하나의 프로토타입에 할당된다. 선택된 프로토타입은 의미적 기준점으로 작용하며, 연속적인 잔차는 해당 프로토타입 주변의 샘플별 국소 변이를 보존한다. 디코더는 이러한 프로토타입-잔차 표현으로부터 이미지를 복원하거나 생성함으로써, 여러 샘플이 공유하는 의미 구조와 세부적인 개별 변이를 분리할 수 있다.
학습된 인코더와 디코더의 동작을 사전에 정의된 계층 구조와 정렬하기 위해, 제안한 생성모델은 프로토타입 의미 학습, maximum mean discrepancy 기반 잠재공간 분산, 그리고 구조적 정규화를 결합한다. 프로토타입 의미 학습은 고정된 프로토타입이 대표적인 시각적 기준점으로 디코딩되도록 유도하며, 분포 정합 목적함수는 잠재 표현이 좁은 영역으로 붕괴 하는 것을 방지하고 쌍곡 잠재공간의 보다 넓은 영역에 분포하도록 한다. MNIST와 CelebA 를 이용한 실험에서는 프로토타입 디코딩과 방사형 디코딩을 통해 해석 가능한 coarse-to-fine 특성이 나타남을 확인하였다. 이러한 결과는 고정된 쌍곡 프로토타입 트리가 이미지 복원과 생성을 위한 효과적이고 해석 가능한 구조적 기반으로 활용될 수 있음을 보여준다.
종합하면, 본 학위논문은 데이터가 부족하고 잡음이 많은 감각 데이터의 강건한 분류에서 출발하여, 기하 구조를 고려한 표현 학습과 해석 가능한 생성으로 이어지는 통합적인 연구 흐름을 제시한다. 실험 결과는 적절하게 설계된 데이터 증강, 프로토타입 기반 학습, 그리고 쌍곡 잠재공간이 판별 모델과 생성모델 모두에서 강건성, 효율성, 해석 가능성을 향상할 수 있음을 보여준다.|This dissertation investigates deep learning methods for data that are difficult to acquire, limited in quantity, highly noisy, and structurally complex. The research begins with artificial taste perception using an electronic tongue and extends toward interpretable latent-space design for generative modeling. Across the studies, the central objective is to develop learning algorithms that remain robust under data scarcity and measurement noise while providing meaningful representations of the underlying data geometry. Electronic-tongue data present several practical limitations. Measurements require substantial time because each sensor must respond to a stimulus and then be cleaned to prevent cross-contamination. In addition, repeated use can cause sensor degradation, food samples may change through oxidation, and anomalous measurements may arise during acquisition. These factors make large-scale taste datasets difficult to construct and increase the risks of overfitting and sensitivity to outliers. To address these limitations, the first study introduced a customized data augmentation strategy that combines basic taste measurements within the same flavor category to substantially in- crease the number of available samples. A prototype-based deep neural network classifier was then used to organize encoded taste data according to distances from class representatives. Bootstrap sampling and voting mechanisms were further incorporated to improve stability and reduce the influence of abnormal measurements. Experiments on wine data demonstrated that the proposed framework could achieve reliable classification performance despite the small and noisy nature of the dataset. The second study focused on the geometry of the latent representation. Conventional neural networks generally assume that encoded data lie in a flat Euclidean space, although many datasets contain hierarchical or non-Euclidean relationships that may not be represented efficiently in such a geometry. To reduce representation distortion and improve robustness, taste features extracted by a deep neural network were embedded into the Poincaré ball, a model of hyperbolic space with constant negative curvature. Classification was performed using hyperbolic distances between each sample and class prototypes represented by Einstein midpoints. The resulting model achieved higher accuracy than Euclidean embedding and previous voting-based approaches, particularly under severe measurement noise. Because the hyperbolic model used a single network rather than multiple voting networks, it also reduced computational cost and training time. Additional experiments with previously unseen wine samples showed that the learned hyperbolic representation could identify similar known wines more effectively, suggesting potential applications in taste-based recommendation systems. The final study extended the investigation from discriminative learning to generative modeling by addressing the lack of explicit and interpretable organization in conventional continuous latent spaces. A hyperbolic prototype- residual autoencoder was proposed, in which a fixed prototype tree is embedded in the Poincaré ball and used as a structural scaffold for latent representations. Each encoded sample is assigned to a prototype according to hyperbolic distance. The selected prototype acts as a semantic anchor, while a continuous residual preserves local, instance-specific variation around that prototype. The decoder reconstructs or generates images from this prototype-residual representation, enabling the model to separate shared semantic structure from fine-grained variation. To align the learned encoder-decoder behavior with the predefined hierarchy, the generative framework combines prototype semantic learning, maximum mean discrepancy-based latent spreading, and structural regu- larization. Prototype semantic learning encourages fixed prototypes to decode into representative visual anchors, while the distribution-matching objective prevents latent representations from collapsing into narrow regions and encourages them to occupy a broader portion of the hyperbolic space. Experiments on MNIST and CelebA demon- strated interpretable coarse-to-fine behavior through prototype decoding and radial decoding. These results indicate that a fixed hyperbolic prototype tree can provide an effective and interpretable scaffold for image reconstruction and generation. Overall, this dissertation presents a unified progression from robust classification of scarce and noisy sensory data to geometry-aware representation learning and interpretable generation. The results demonstrate that care- fully designed augmentation, prototype-based learning, and hyperbolic latent geometry can improve robustness, efficiency, and interpretability across both discriminative and generative tasks.
